I Tested Three AI Essay-writing Tools, and Here’s What I Found

Writing essays can be draining, tedious, and difficult, even for me—and I write all day long for a living. If writing isn’t your special skill, it’s even harder, which is why there are so many sites and products out there that are designed to help you get your homework done. Some of them are pretty unethical, and I’m not going to recommend hiring someone else to write your papers for you, but there are some cool AI tools that can give you a hand that are worth considering. (The essay-writing businesspeople are probably using these, too, so you’re better off eliminating the middleman and using them on your own.)

The best AI essay-helper tools

I have an essay due next week on the history and impact of a federal law, 21 U.S.C. S856, which outlaws the operation of any building where drugs are made or used. I won’t lie: I’m excited to work on it this weekend, but that’s just me. I tested out a few of the more popular AI essay-helper tools, pretending I wasn’t excited about it, to see how they worked. Here’s my assessment. 

First up was Grammarly , which prompted me to fill out a personalization quiz before I could use it. I told the site I was a grad student, interested in improving the vocabulary I use in my work, and looking to brainstorm topics for my essay. I used the text-input section to type a quick introductory paragraph and selected “Generative AI” from the list of options. When I hit the “Improve It” button, Grammarly showed me a revised version that added a bunch of words, but still said the same thing as my more concise entry. To me, that’s annoying, but if you’re trying to hit a word count, this could be useful. I was also given options like “Make it assertive,” “Make it persuasive,” and “Make it confident.” When I selected “Make it more detailed,” the generative AI did expand the information pretty significantly, but it didn’t add any citations and I’m not convinced it drew on material outside of what I inputted. When I hit “Make it persuasive,” the AI automatically assumed the bias should fall in favor of the law, but when I added more detail to my original paragraph, suggesting for argument’s sake that the law has curtailed efforts to reduce drug overdoses throughout the country, the AI assistant said, “Grammarly assistance is unavailable for this prompt because it may result in sensitive content.”

Overall, this wasn’t great for my needs, as my topic's content was too “sensitive” and the generative AI really only added a bunch of words. This one would be most useful for someone trying to hit a word count. 

Next I tested Cramly , which I hadn’t heard of before. Before upgrading to a $4/month plan, you do get to try five free prompts, so I pasted my basic intro paragraph in there and, after a few seconds, got five paragraphs in return. It was obvious the AI was pulling from external sources somehow, as it mentioned fines and prison sentences associated with the law that I hadn’t specified, but it didn’t actually cite those sources. Still, the information it provided was helpful, so this one would be great if you’re not sure how to frame or expand on a topic and need a general idea of what your essay could look like. You’ll just have to go through everything it spits back at you and look it up independently, finding solid sourcing. 

EssayGenius

EssayGenius is extremely easy to use. It asked me to type what I’m writing about into a box. I simply inputted the name of the law and, about 10 seconds later, got 10 paragraphs back, some with subheadings like “historical background” and “implications in criminal law and public policy.” Again, there were no citations here, but the service provided not only a lot of details that could be used as a springboard to find more, but a solid outline for what the paper could look like. The AI played both sides, objectively presenting the cases for and against the law, then provided a conclusion that made it easy to narrow down where to go with the topic. Impressively, I was able to generate all that for free, but if you want to write up to 10 essays per month, it’ll cost you $9.99 a month. 

Finally, I tried out JotBot , which I have seen advertised on social media. It asked me what I was writing about, plus if I wanted an outline, but also gave me an opportunity to upload my old essays so it could replicate my writing style. As scary as it was, the paragraphs it generated after reading some of my older work did sound more like me than standard AI does. It give me subtopic suggestions, like “impact,” “historical background,” and “controversies,” which I could select from a sidebar and, if I liked the paragraph it wrote, drag into the essay itself. From there, I could accept or reject sentences one by one as it generated new ones. I could write in the essay editing section, too, and it generated more suggestions based on what I was typing. Frankly, this one was really cool and I can see how it would help beat writer’s block with ease, since you can type and get suggestions as you go. There was a learning curve, though, and I didn’t realize how quickly I was blowing through my 10 free daily “credits,” since it’s unclear what, exactly, costs credits and how many it costs to, say, accept one suggestion. You can unlock unlimited credits, unlimited autocomplete, unlimited sources, and more for $14 per month. 

Conclusions

Overall, EssayGenius and JotBot were the best AI tools I tested. I was impressed by EssayGenius’s ability to research the topic on its own and JotBot’s mimicry of my own writing style. They do cost money, but that might be worth it if you’re someone who struggles with idea generation, outline creation, or getting into the flow of writing overall. 

Bear in mind these are not meant to churn out entire essays for you and you shouldn’t use them to do that. I don’t mean because it’s unethical, but I mean because it’s pretty easy for professors to catch you doing it . Even if you do use an AI tool to generate a whole paragraph or more, try to write it in your own voice and think of it more as a way to study and learn about your topic than have the writing done for you. 

Or, pay nothing and just use ChatGPT to generate outline ideas. I do that all the time and never have to worry about getting in trouble, cheating myself out of an education, or paying for anything. I just asked ChatGPT to generate an outline for an essay on 21 U.S.C. §856 and its impact on American harm reduction efforts and got eight sections, each with three subsections, and an easy roadmap I could follow to write my paper on my own. Doing it this way ensures I’ll actually research and learn about the topic, which is important to me, but also avoid the risk of going down for plagiarism or cheating, which is probably important to you.

• Identify and research your essay topic — find a particular angle that interests you.

If writing an argument intimidates you, this five-step list will break your essay into manageable chunks, making it easier to write.

• Identify a topic or issue that is arguable from more than one position . You must form an opinion and not argue a simple fact. Find a topic that has multiple theories and no conclusive evidence, such as “Is animal testing ethical?” or “Should students still study Shakespeare?”
• Use research to create your thesis (follow the steps mentioned earlier).
• Find evidence to back up your thesis . Double-check sources for credibility and try to spot missing information that could impact your argument.
• Address opposing ideas others may hold . Use search engines such as Google to research opposite arguments. For instance, if I believe animal testing is not ethical, I can research “Why animal testing is ethical” to find other theories. To respecfully show different opinions, first acknowledge the opposing view and evidence. Then, share your argument and provide logical evidence as to why your argument is the correct one.
• Create a convincing conclusion . Rather than repeating what you’ve already said, draw from the arguments you’ve made and point out how they logically prove your thesis.

Since OpenAI launched ChatGPT in 2022, educators have been grappling with the problem of how to recognize and address AI-generated writing. The host of AI-detection tools that have emerged over the past year vary greatly in their capabilities and reliability. For example, mere months after OpenAI launched its own AI detector, the company shut it down due to its low accuracy rate.

Understandably, students have expressed concerns over the possibility of their work receiving false positives as AI-generated content. Some institutions have disabled Turnitin’s AI-detection feature due to concerns over potential false allegations of AI plagiarism that may disproportionately affect English-language learners . At the same time, tools that rephrase AI writing—such as text spinners, text inflators or text “humanizers”—can effectively disguise AI-generated text from detection. There are even tools that mimic human typing to conceal AI use in a document’s metadata.

While the capabilities of large language models such as ChatGPT are impressive, they are also limited, as they strongly adhere to specific formulas and phrasing . Turnitin’s website explains that its AI-detection tool relies on the fact that “GPT-3 and ChatGPT tend to generate the next word in a sequence of words in a consistent and highly probable fashion.” I am not a computer programmer or statistician, but I have noticed certain attributes in text that point to the probable involvement of AI, and in February, I collected and quantified some of those characteristics in hopes to better recognize AI essays and to share those characteristics with students and other faculty members.

I asked ChatGPT 3.5 and the generative AI tool included in the free version of Grammarly each to generate more than 50 analytical essays on early American literature, using texts and prompts from classes I have taught over the past decade. I took note of the characteristics of AI essays that differentiated them from what I have come to expect from their human-composed counterparts. Here are some of the key features I noticed.

AI essays tend to get straight to the point. Human-written work often gradually leads up to its topic, offering personal anecdotes, definitions or rhetorical questions before getting to the topic at hand.

AI-generated essays are often list-like. They may feature numbered body paragraphs or multiple headings and subheadings.

The paragraphs of AI-generated essays also often begin with formulaic transitional phrases. As an example, here are the first words of each paragraph in one essay that ChatGPT produced:

• “In contrast”
• “Furthermore”
• “On the other hand”
• “In conclusion.”

Notably, AI-generated essays were far more likely than human-written essays to begin paragraphs with “Furthermore,” “Moreover” and “Overall.”

AI-generated work is often banal. It does not break new ground or demonstrate originality; its assertions sound familiar.

AI-generated text tends to remain in the third person. That’s the case even when asked a reader response–style question. For example, when I asked ChatGPT what it personally found intriguing, meaningful or resonant about one of Edgar Allan Poe’s poems, it produced six paragraphs, but the pronoun “I” was included only once. The rest of the text described the poem’s atmosphere, themes and use of language in dispassionate prose. Grammarly prefaced its answer with “I’m sorry, but I cannot have preferences as I am an AI-powered assistant and do not have emotions or personal opinions,” followed by similarly clinical observations about the text.

AI-produced text tends to discuss “readers” being “challenged” to “confront” ideologies or being “invited” to “reflect” on key topics. In contrast, I have found that human-written text tends to focus on hypothetically what “the reader” might “see,” “feel” or “learn.”

AI-generated essays are often confidently wrong. Human writing is more prone to hedging, using phrases like “I think,” “I feel,” “this might mean …” or “this could be a symbol of …” and so on.

AI-generated essays are often repetitive. An essay that ChatGPT produced on the setting of Rebecca Harding Davis’s short story “Life in the Iron Mills” contained the following assertions among its five brief paragraphs: “The setting serves as a powerful symbol,” “the industrial town itself serves as a central aspect of the setting,” “the roar of furnaces serve as a constant reminder of the relentless pace of industrial production,” “the setting serves as a catalyst for the characters’ struggles and aspirations,” “the setting serves as a microcosm of the larger societal issues of the time,” and “the setting … serves as a powerful symbol of the dehumanizing effects of industrialization.”

AI writing is often hyperbolic or overreaching. The quotes above describe a “powerful symbol,” for example. AI essays frequently describe even the most mundane topics as “groundbreaking,” “vital,” “esteemed,” “invaluable,” “indelible,” “essential,” “poignant” or “profound.”

AI-produced texts frequently use metaphors, sometimes awkwardly. ChatGPT produced several essays that compared writing to “weaving” a “rich” or “intricate tapestry” or “painting” a “vivid picture.”

AI-generated essays tend to overexplain. They often use appositives to define people or terms, as in “Margaret Fuller, a pioneering feminist and transcendentalist thinker, explored themes such as individualism, self-reliance and the search for meaning in her writings …”

AI-generated academic writing often employs certain verbs. They include “delve,” “shed light,” “highlight,” “illuminate,” “underscore,” “showcase,” “embody,” “transcend,” “navigate,” “foster,” “grapple,” “strive,” “intertwine,” “espouse” and “endeavor.”

AI-generated essays tend to end with a sweeping broad-scale statement. They talk about “the human condition,” “American society,” “the search for meaning” or “the resilience of the human spirit.” Texts are often described as a “testament to” variations on these concepts.

AI-generated writing often invents sources. ChatGPT can compose a “research paper” using MLA-style in-text parenthetical citations and Works Cited entries that look correct and convincing, but the supposed sources are often nonexistent. In my experiment, ChatGPT referenced a purported article titled “Poe, ‘The Fall of the House of Usher,’ and the Gothic’s Creation of the Unconscious,” which it claimed was published in PMLA , vol. 96, no. 5, 1981, pp. 900–908. The author cited was an actual Poe scholar, but this particular article does not appear on his CV, and while volume 96, number 5 of PMLA did appear in 1981, the pages cited in that issue of PMLA actually span two articles: one on Frankenstein and one on lyric poetry.

AI-generated essays include hallucinations. Ted Chiang’s article on this phenomenon offers a useful explanation for why large language models such as ChatGPT generate fabricated facts and incorrect assertions. My AI-generated essays included references to nonexistent events, characters and quotes. For example, ChatGPT attributed the dubious quote “Half invoked, half spontaneous, full of ill-concealed enthusiasms, her wild heart lay out there” to a lesser-known short story by Herman Melville, yet nothing resembling that quote appears in the actual text. More hallucinations were evident when AI was generating text about less canonical or more recently published literary texts.

This is not an exhaustive list, and I know that AI-generated text in other formats or relating to other fields probably features different patterns and tendencies . I also used only very basic prompts and did not delineate many specific parameters for the output beyond the topic and the format of an essay.

It is also important to remember that the attributes I’ve described are not exclusive to AI-generated texts. In fact, I noticed that the phrase “It is important to … [note/understand/consider]” was a frequent sentence starter in AI-generated work, but, as evidenced in the previous sentence, humans use these constructions, too. After all, large language models train on human-generated text.

And none of these characteristics alone definitively point to a text having been created by AI. Unless a text begins with the phrase “As an AI language model,” it can be difficult to say whether it was entirely or partially generated by AI. Thus, if the nature of a student submission suggests AI involvement, my first course of action is always to reach out to the student themselves for more information. I try to bear in mind that this is a new technology for both students and instructors, and we are all still working to adapt accordingly.

Students may have received mixed messages on what degree or type of AI use is considered acceptable. Since AI is also now integrated into tools their institutions or instructors have encouraged them to use—such as Grammarly , Microsoft Word or Google Docs —the boundaries of how they should use technology to augment human writing may be especially unclear. Students may turn to AI because they lack confidence in their own writing abilities. Ultimately, however, I hope that by discussing the limits and the predictability of AI-generated prose, we can encourage them to embrace and celebrate their unique writerly voices.

You can also prompt these tools to provide feedback on your work to improve the clarity or consistency of your writing. However, it’s important not to upload sensitive information, as user inputs are generally saved by the tool for the purposes of training future models.

How to spot AI-generated text

The internet is increasingly awash with text written by AI software. We need new tools to detect it.

This sentence was written by an AI—or was it? OpenAI’s new chatbot, ChatGPT, presents us with a problem: How will we know whether what we read online is written by a human or a machine?

Since it was released in late November, ChatGPT has been used by over a million people. It has the AI community enthralled, and it is clear the internet is increasingly being flooded with AI-generated text. People are using it to come up with jokes, write children’s stories, and craft better emails. 

ChatGPT is OpenAI’s spin-off of its large language model GPT-3 , which generates remarkably human-sounding answers to questions that it’s asked. The magic—and danger—of these large language models lies in the illusion of correctness. The sentences they produce look right—they use the right kinds of words in the correct order. But the AI doesn’t know what any of it means. These models work by predicting the most likely next word in a sentence. They haven’t a clue whether something is correct or false, and they confidently present information as true even when it is not. 

In an already polarized, politically fraught online world, these AI tools could further distort the information we consume. If they are rolled out into the real world in real products, the consequences could be devastating. 

We’re in desperate need of ways to differentiate between human- and AI-written text in order to counter potential misuses of the technology, says Irene Solaiman, policy director at AI startup Hugging Face, who used to be an AI researcher at OpenAI and studied AI output detection for the release of GPT-3’s predecessor GPT-2. 

New tools will also be crucial to enforcing bans on AI-generated text and code, like the one recently announced by Stack Overflow, a website where coders can ask for help. ChatGPT can confidently regurgitate answers to software problems, but it’s not foolproof. Getting code wrong can lead to buggy and broken software, which is expensive and potentially chaotic to fix. 

A spokesperson for Stack Overflow says that the company’s moderators are “examining thousands of submitted community member reports via a number of tools including heuristics and detection models” but would not go into more detail. 

In reality, it is incredibly difficult, and the ban is likely almost impossible to enforce.

Today’s detection tool kit

There are various ways researchers have tried to detect AI-generated text. One common method is to use software to analyze different features of the text—for example, how fluently it reads, how frequently certain words appear, or whether there are patterns in punctuation or sentence length. 

“If you have enough text, a really easy cue is the word ‘the’ occurs too many times,” says Daphne Ippolito, a senior research scientist at Google Brain, the company’s research unit for deep learning. 

Because large language models work by predicting the next word in a sentence, they are more likely to use common words like “the,” “it,” or “is” instead of wonky, rare words. This is exactly the kind of text that automated detector systems are good at picking up, Ippolito and a team of researchers at Google found in research they published in 2019.

But Ippolito’s study also showed something interesting: the human participants tended to think this kind of “clean” text looked better and contained fewer mistakes, and thus that it must have been written by a person. 

In reality, human-written text is riddled with typos and is incredibly variable, incorporating different styles and slang, while “language models very, very rarely make typos. They’re much better at generating perfect texts,” Ippolito says. 

“A typo in the text is actually a really good indicator that it was human written,” she adds. 

Large language models themselves can also be used to detect AI-generated text. One of the most successful ways to do this is to retrain the model on some texts written by humans, and others created by machines, so it learns to differentiate between the two, says Muhammad Abdul-Mageed, who is the Canada research chair in natural-language processing and machine learning at the University of British Columbia and has studied detection . 

Scott Aaronson, a computer scientist at the University of Texas on secondment as a researcher at OpenAI for a year, meanwhile, has been developing watermarks for longer pieces of text generated by models such as GPT-3—“an otherwise unnoticeable secret signal in its choices of words, which you can use to prove later that, yes, this came from GPT,” he writes in his blog. 

A spokesperson for OpenAI confirmed that the company is working on watermarks, and said its policies state that users should clearly indicate text generated by AI “in a way no one could reasonably miss or misunderstand.” 

But these technical fixes come with big caveats. Most of them don’t stand a chance against the latest generation of AI language models, as they are built on GPT-2 or other earlier models. Many of these detection tools work best when there is a lot of text available; they will be less efficient in some concrete use cases, like chatbots or email assistants, which rely on shorter conversations and provide less data to analyze. And using large language models for detection also requires powerful computers, and access to the AI model itself, which tech companies don’t allow, Abdul-Mageed says. 

The bigger and more powerful the model, the harder it is to build AI models to detect what text is written by a human and what isn’t, says Solaiman. 

“What’s so concerning now is that [ChatGPT has] really impressive outputs. Detection models just can’t keep up. You’re playing catch-up this whole time,” she says. 

Training the human eye

There is no silver bullet for detecting AI-written text, says Solaiman. “A detection model is not going to be your answer for detecting synthetic text in the same way that a safety filter is not going to be your answer for mitigating biases,” she says. 

To have a chance of solving the problem, we’ll need improved technical fixes and more transparency around when humans are interacting with an AI, and people will need to learn to spot the signs of AI-written sentences. 

“What would be really nice to have is a plug-in to Chrome or to whatever web browser you’re using that will let you know if any text on your web page is machine generated,” Ippolito says.

Some help is already out there. Researchers at Harvard and IBM developed a tool called Giant Language Model Test Room (GLTR), which supports humans by highlighting passages that might have been generated by a computer program. 

But AI is already fooling us. Researchers at Cornell University found that people found fake news articles generated by GPT-2 credible about 66% of the time. 

Another study found that untrained humans were able to correctly spot text generated by GPT-3 only at a level consistent with random chance.  

The good news is that people can be trained to be better at spotting AI-generated text, Ippolito says. She built a game to test how many sentences a computer can generate before a player catches on that it’s not human, and found that people got gradually better over time. 

“If you look at lots of generative texts and you try to figure out what doesn’t make sense about it, you can get better at this task,” she says. One way is to pick up on implausible statements, like the AI saying it takes 60 minutes to make a cup of coffee.

AI tools are available today that can write compelling university level essays. Taking an example of sample essay produced by the GPT-3 transformer, Mike Sharples discusses the implications of this technology for higher education and argues that they should be used to enhance pedagogy, rather than accelerating an ongoing arms race between increasingly sophisticated fraudsters and fraud detectors.

  With all the focus in artificial intelligence and education on AI personalised learning and tutoring systems , one AI technology has slipped by unnoticed. It could become a gift for student cheats, or a powerful teaching assistant, or a tool for creativity. It’s called a Transformer, it acts as a universal language tool and it is set to disrupt education. Here’s how.

Take a minute to read this graduate student essay on the controversial topic of “learning styles”. If this were your student, how would you assess the essay? What mark would you give? What are its strengths and weaknesses?

Learning Styles

The construct of “learning styles” is problematic because it fails to account for the processes through which learning styles are shaped. Some students might develop a particular learning style because they have had particular experiences. Others might develop a particular learning style by trying to accommodate to a learning environment that was not well suited to their learning needs. Ultimately, we need to understand the interactions among learning styles and environmental and personal factors, and how these shape how we learn and the kinds of learning we experience.

Learning styles and learning modes

In the 1970s, learning styles became an important feature of educational practice. In the 1990s, “learning modalities” became a major focus of learning style research. This is the idea that we process information in different ways. For example, some individuals may be auditory learners, benefiting from listening to lectures and using recorded materials. Others may be visual learners, who gain from using visual materials such as textbooks, handouts, and computer graphics. Still others may be kinesthetic learners, who benefit from learning by movement and doing. Numerous experiments have been conducted to test this idea, and a number of different classifications of learning modalities have been proposed.

In a review of this research, Dunn and Dunn (1997) found that the evidence does not support the idea that people have a particular learning mode that is dominant or that they process information in a particular way. In their study, the authors found that when students were given a particular instructional treatment, they could be classified in a particular learning modality category. But when they were given a different instructional treatment, they were classified in a different category. In a follow-up study in which they gave students a number of instructional treatments, Dunn and Dunn found that students could be placed in a particular category in some treatments, but not others.

Dunn and Dunn also found that the results varied by age. Older students generally fit the results of more than one modality, whereas younger students were more likely to fit the results of just one modality. This led them to conclude that style preferences are learned over the course of development. This is consistent with the idea that people are flexible in responding to the way they are taught.

The entire “student essay” was written by a Transformer AI program, GPT-3 . I gave it the prompt “The construct of ‘learning styles’ is problematic because” and it produced the rest, including headings and references. Plagiarism software will not detect essays written by Transformers, because the text is generated, not copied. A Google search of the essay shows that each sentence is original.

Note its reference for “Dunn and Dunn (1997)”. There is a journal of Research in Education, but no issue 7(2) in 1997. Dunn and Dunn did publish on learning styles, but not in that journal. GPT-3 has fashioned a plausible-looking but fake reference. It has also invented a fictitious research study from Dunn and Dunn to critique learning styles.

Anyone can sign up for an account with the GPT-3 Transformer then go to its “Playground”, type the opening words of an assignment, press Submit and let it do the rest. A student can now generate an entire essay or assignment in seconds, at a cost of around 1 US cent. Other companies and universities are developing Transformer systems that write in multiple languages and learn as they go.

Some Transformers, such as GPT-3, can filter bad language. But they are essentially amoral. They don’t know what they have written – they can’t reflect on their output. Can a powerful but amoral text generator be used for good in education? Here are some suggestions.

Just as a student can generate an essay in seconds, so a teacher can assess it. Add “Here is a short assessment of this student essay:” to the end of the text and GPT-3 writes a review.

The essay discusses the idea of learning styles, and how they may be developed over time. It cites research by Dunn and Dunn which suggests that learning styles are not fixed, and that people can learn in different ways depending on the situation.

The essay is well-organized and flows smoothly. It makes a clear argument and supports it with evidence from research.

One potential criticism is that the essay does not discuss the implications of learning styles research, or how this research can be used to improve learning. However, this is not necessarily a flaw, as the essay is only meant to be a brief overview of the topic.

It does a reasonable job. The program transforms surface text into a review but it doesn’t get to the essay’s meaning, nor does it find the fake reference or the made-up research study.

Students will employ AI to write assignments. Teachers will use AI to assess them. Nobody learns, nobody gains. If ever there were a time to rethink assessment, it’s now. Instead of educators trying to outwit AI Transformers, let’s harness them for learning.

If Transformer AI systems have a lasting influence on education, maybe that will come from educators and policy makers having to rethink how to assess students

First, Transformers can quickly show students different ways to express ideas and structure assignments. A teacher can run a classroom exercise to generate a few assignments on a topic, then get students to critique them and write their own better versions.

Second, AI Transformers can be creativity tools. Each student writes a short story with an AI. The student writes the first paragraph, AI continues with the second, and so on. It’s a good way to explore possibilities and overcome writer’s block.

Third, teachers can explore the ethics and limits of AI . How does it feel to interact with an expert wordsmith that has no morals and no experience of the world? Does a “deep neural network” have a mind, or is it just a big data processor?

Finally, as educators, if we are setting students assignments that can be answered by AI Transformers, are we really helping students learn? There are many better ways to assess for learning : constructive feedback, peer assessment, teachback. If Transformer AI systems have a lasting influence on education, maybe that will come from educators and policy makers having to rethink how to assess students, away from setting assignments that machines can answer, towards assessment for learning.

Many thanks Mike, a really interesting and thought-provoking piece. I wonder if you’d be able to share the settings you used on GPT-3 to generate the essay above? I’ve not been able to reproduce anything close using the same prompt, which I’m sure is due to my lack of knowledge about the technology. Thanks.

I used the standard settings with the Davinci GPT-3 engine, apart from setting “maximum length” to 2000. It generated the text as shown, up to “they are taught.”. I then appended “References” and GPT-3 added the reference, as shown.

Thanks so much Mike! Really interesting. I wouldn’t expect to get the same result as you – I guess that’s the whole point. GPT-3 should be “creating” an original answer for anyone who puts in the same prompt (and students are unlikely to use the same prompt anyway).

Some of the first attempts gave me a pretty underwhelming attempt at an essay that might just pass for something a 14-year old could write, but nothing at UG or PG level. So I carried on playing around.

I’ve since reset all settings and have set maximum length to 2000 as per your query, and am getting the following:

“The concept of ‘learning styles’ is problematic because it is based on the idea that there is a single way to learn that is optimal for each individual. However, research has shown that there is no evidence to support the existence of learning styles. Furthermore, the idea of learning styles can actually be harmful, as it can lead students to believe that they cannot learn in any other way than their preferred style. This can lead to students feeling discouraged and unmotivated when they are faced with material that they find difficult to learn using their preferred style.”

Even some tweaking of settings doesn’t seem to encourage GPT-3 to give me any more than this. I wonder how much it might depend on my previous use of Playground, and whether I can “train” GPT-3 to give me “better” responses in future?

I’ll be really interested to see if anyone else tries this and what they get. Thanks so much for getting me thinking about this Mike!

The latest version of GPT-3 has been trained to accept instructions, such as “Write a student essay on the topic of ‘A critique of learning styles'”. I was using an earlier version trained for text continuation. You could either try with the earlier version (it should still be available on the OpenAI Playground), or try giving the be version a direct instruction.

Thank you for this! I think you’ve really helped frame an important discussion about using LLM transformers to help students learn. However, I am curious about what sort of essays or writing in general we as educators could assign that a GPT-3 could not eventually answer?

I think Google’s LaMDA transformer contains nearly ten fold the amount of data engineers used with GPT-3, even causing the bizarre Google employee episode where he tried to convince folks that it had become sentient (it isn’t, of course). However, as transformers develop and progress I don’t really know what sort of assignments we can come up with that only a human could write.

Even SudoWrite’s algorithm can do a fairly decent job of mimicking phrases and moments of empathy, so I assume that transformers will be able to tackle creative writing one day.

Maybe the key is to continually engage students through co-writing with AI and let them practice critical thinking, self assessment, and reflection by emphasizing that an AI, when used effectively, can help an immature writer’s process or even a mature writer who suffers from decision fatigue.

Inspiring stuff Mike and your perspectives that move away form the sensationalist approach of the negative connotations of AI in education, are refreshing to see. I have taken a look at the tools you used and tried them out for myself. The one thing I am not able to represent is the length of the piece you were able to get the AI to produce. There’s a very simple way to control the abuse of “AI” to write student essays – the personal tutorial where the student has to read their essay out and be questioned on it. This has worked well in the past. Maybe it’s time to revive it.

In an attempt to cut down on plagiarism and purchased papers, I revised my assignments so that they were both scaffolded and required the use of assigned sources. When outside research is required, students must justify the reliability of the sources. Requiring regular annotated responses to the readings also gives me the ability to see when essays seem to be in line with student work. Based on my limited exploration of the app, that approach also seems to address the problems raised by the new technology.

The problem is that it requires a lot more grading on my part than the traditional exam-essay assessment approach, but I don’t see that very much anymore.

Suppose students were asked to integrate their own personal experiences with learning styles (or any topic of an assignment) and specific examples from different points in their life where they learned to learn as they do, how would AI handle that? Since our individual experiences are points on a distribution captured in research data, could application of research to understand experience help!

Mike, when I tried this on different topics with “citations” requested, it produced all fake citations. Plausible looking, but fake. A student doing that would likely fail! Or at the least be in for a grilling and a stern warning. So, I don’t think ChatGPT is much of a threat as a source of academic misconduct. Just ask for references and check them to catch chancers taken in by the hype.

Benjamin’s technology used LSTM, which came before GPT-3 technology. Sharp trained it on Science Fiction screenplays – a little better than Batman movies.

His short film Sunspring is a science-fiction movie about a futuristic world featuring three main characters. This was the only certain information AI outlined in its movie script. At that point, the rest of the plot is up to interpretation. Benjamin the AI may have pulled inspiration for the setting from a space station.

The opening line of the script, spoken by a man at a computer wearing a shiny gold suit, goes like this:

They exist from the most basic that perform simple tasks, to the most complex that achieve the same performance as a person with university degrees. Each day different types of machines are built, which perform simple or complex tasks faster than a person. This is leading to increased efficiency for businesses. In their study, Masayuki Morikawa surveyed more than 3000 Japanese businesses and found that they were positive on the increase of AI being used in their company. They also found that the use of AI complimented the skills of current employees with higher degrees, creating a demand for better workers (2016). The benefits and the opportunities with the use of artificial intelligence can help in many ways; Increasing the finances of a business, improving the security this technology could help to diminish the risk of viruses, or solve them and keep companies safe from cyber attacks. In other things for many people this can be a good start for their economy and to be able to maintain control over what they can buy or where it is much better to invest. “AI technology is increasingly providing us with new knowledge and information about our actions. Fueled by sensors, data digitization, and ever-increasing connectedness, AI filters, associates, prioritizes, classifies, measures, and predicts outcomes, allowing the federal government to make more informed, data-driven decisions” (Maughn 2018).

The data-driven decisions the federal government makes is already showing. The testimony of Douglas Maughan state that AI has assisted the Department of Homeland Security in preventing attacks against critical infrastructure like banks and 911 centers. He also spoke about the ability of AI to help with intelligence gathering. For example, Customs and Border Protection has used AI to try and identify travelers that could be a threat to the country (2018).

In terms of employment for people, once AI becomes used more and more, there are concerns expressed by many. Adam Butler quotes that “the next 3 years will see half a million more jobs created” but also “more than half of today’s jobs [will become] automated within the next 35 years” (2018). The robots are manufactured to work and act like normal equipment since this is seen every day. To the point of becoming so real in some countries already have robots taking over for people: Mexico occupies 30 with 33 robots for every 100 employees, Argentina occupies the 36 with 16 units and Brazil the number 38 with 11 units. The robots are more and more in the whole world and every time it becomes more real and more present than ever (Morikawa 2016).

Another issue with AI is the fact that despite not being 100% reliable, people still trust it more than a human. Wagner, Borenstein, and Howard give different examples of when people overtrust AI like a robot. In one study, the people were put in a fake emergency situation and instead of following evacuation signs, they listened to the robot even when they were told before that the robot was broken (2018).

This September, the Subcommittee on Information and Technology in the U.S. House of Representatives released a report on AI. While it did have positives for its use, it also spoke about negative things. The malicious use of AI will change the way we build and manage the digital infrastructure as well as our AI system and this will require many answers and more personnel from different industry. What negative effects would the bad management of AI bring us? And how do we prevent this damage to society? The subcommittee hearing also highlighted the need to prepare for and protect against the malicious use of AI. “Earlier this year, Open AI, a non-profit AI research company that testified at one of the hearing, co-authored a report findings that unless adequate defenses are developed, AI progress, will result in cyber attacks that are ‘more effective, more finely targeted, more difficult to attribute, and more likely to exploit vulnerability in AI systems'” (Hurd and Kelly, 2018).

For the future, all the writers agree on several things. The first is that the research in Artificial Intelligence should continue and increase. The federal government wants to stay the leader in research so China cannot beat us (Hurd and Kelly 2018). It also wants to use it to increase use in Homeland Security to protect the nation and the peoples within it (Maughan 2018). Second is that private companies want to use it to make better things that cost less money to make. Robert Atkinson writes that people should not worry about their jobs being taken by robots because companies will still need people to fix the robots which will actually create more jobs. He also says that every time in history when a new technology comes and decreases jobs at first, more jobs come later and that is a benefit for everyone.

In conclusion, the artificial intelligence is achieving a great stability in everyday life. Even though robots can substitute people in critical jobs such as laborers or marketing they cannot have their personal creativity and no emotions. Conversely, we human beings have a huge range. Increasing steps are being taken in terms of machinery and use of these in different points of daily life. Artificial intelligence is a debate between society and those who support the contribution made to help humanity with the problems of hunger and above all poverty. In this process, the definition of the necessary data formats and the corresponding mechanisms to protect security and privacy will be particularly important.

The AI Scientist: Towards Fully Automated Open-Ended Scientific Discovery

At Sakana AI, we have pioneered the use of nature-inspired methods to advance cutting-edge foundation models. Earlier this year, we developed methods to automatically merge the knowledge of multiple LLMs . In more recent work, we harnessed LLMs to discover new objective functions for tuning other LLMs. Throughout these projects, we have been continuously surprised by the creative capabilities of current frontier models. This led us to dream even bigger: Can we use foundation models to automate the entire process of research itself?

Introduction

One of the grand challenges of artificial intelligence is developing agents capable of conducting scientific research and discovering new knowledge. While frontier models have already been used to aid human scientists, e.g. for brainstorming ideas or writing code, they still require extensive manual supervision or are heavily constrained to a specific task.

Today, we’re excited to introduce The AI Scientist , the first comprehensive system for fully automatic scientific discovery, enabling Foundation Models such as Large Language Models (LLMs) to perform research independently. In collaboration with the Foerster Lab for AI Research at the University of Oxford and Jeff Clune and Cong Lu at the University of British Columbia, we’re excited to release our new paper, The AI Scientist: Towards Fully Automated Open-Ended Scientific Discovery .

In our report:

• We propose and run a fully AI-driven system for automated scientific discovery, applied to machine learning research.
• The AI Scientist automates the entire research lifecycle, from generating novel research ideas, writing any necessary code, and executing experiments, to summarizing experimental results, visualizing them, and presenting its findings in a full scientific manuscript.
• We also introduce an automated peer review process to evaluate generated papers, write feedback, and further improve results. It is capable of evaluating generated papers with near-human accuracy.
• The automated scientific discovery process is repeated to iteratively develop ideas in an open-ended fashion and add them to a growing archive of knowledge, thus imitating the human scientific community.
• In this first demonstration, The AI Scientist conducts research in diverse subfields within machine learning research, discovering novel contributions in popular areas, such as diffusion models , transformers , and grokking .

The AI Scientist is designed to be compute efficient. Each idea is implemented and developed into a full paper at a cost of approximately $15 per paper. While there are still occasional flaws in the papers produced by this first version (discussed below and in the report), this cost and the promise the system shows so far illustrate the potential of The AI Scientist to democratize research and significantly accelerate scientific progress.

We believe this work signifies the beginning of a new era in scientific discovery: bringing the transformative benefits of AI agents to the entire research process, including that of AI itself. The AI Scientist takes us closer to a world where endless affordable creativity and innovation can be unleashed on the world’s most challenging problems.

For decades following each major AI advance, it has been common for AI researchers to joke amongst themselves that “now all we need to do is figure out how to make the AI write the papers for us!” Our work demonstrates this idea has gone from a fantastical joke so unrealistic everyone thought it was funny to something that is currently possible.

Overview of The AI Scientist

The AI Scientist is a fully automated pipeline for end-to-end paper generation, enabled by recent advances in foundation models. Given a broad research direction starting from a simple initial codebase, such as an available open-source code base of prior research on GitHub, The AI Scientist can perform idea generation, literature search, experiment planning, experiment iterations, figure generation, manuscript writing, and reviewing to produce insightful papers. Furthermore, The AI Scientist can run in an open-ended loop, using its previous ideas and feedback to improve the next generation of ideas, thus emulating the human scientific community.

Conceptual illustration of The AI Scientist . The AI Scientist first brainstorms a set of ideas and then evaluates their novelty. Next, it edits a codebase powered by recent advances in automated code generation to implement the novel algorithms. The Scientist then runs experiments to gather results consisting of both numerical data and visual summaries. It crafts a scientific report, explaining and contextualizing the results. Finally, the AI Scientist generates an automated peer review based on top-tier machine learning conference standards. This review helps refine the current project and informs future generations of open-ended ideation.

The AI Scientist has 4 main processes, described next.

Idea Generation . Given a starting template, The AI Scientist first “brainstorms” a diverse set of novel research directions. We provide The AI Scientist with a starting code “template” of an existing topic we wish to have The AI Scientist further explore. The AI Scientist is then free to explore any possible research direction. The template also includes a LaTeX folder that contains style files and section headers, for paper writing. We allow it to search Semantic Scholar to make sure its idea is novel.

Experimental Iteration . Given an idea and a template, the second phase of The AI Scientist first executes the proposed experiments and then obtains and produces plots to visualize its results. It makes a note describing what each plot contains, enabling the saved figures and experimental notes to provide all the information required to write up the paper.

Paper Write-up . Finally, The AI Scientist produces a concise and informative write-up of its progress in the style of a standard machine learning conference proceeding in LaTeX. It uses Semantic Scholar to autonomously find relevant papers to cite.

Automated Paper Reviewing . A key aspect of this work is the development of an automated LLM-powered reviewer, capable of evaluating generated papers with near-human accuracy. The generated reviews can be used to either improve the project or as feedback to future generations for open-ended ideation. This enables a continuous feedback loop, allowing The AI Scientist to iteratively improve its research output.

When combined with the most capable LLMs, The AI Scientist is capable of producing papers judged by our automated reviewer as “Weak Accept” at a top machine learning conference.

Example Papers Generated by The AI Scientist

Here, we highlight some of the machine learning papers The AI Scientist has generated, demonstrating its capacity to discover novel contributions in areas like diffusion modeling, language modeling, and grokking. In our full report, we do a deeper dive into the generated papers and provide more analysis on their strengths and weaknesses.

Diffusion Modeling

Language modeling, limitations and challenges.

In its current form, The AI Scientist has several shortcomings. We expect all of these will improve, likely dramatically, in future versions with the inclusion of multi-modal models and as the underlying foundation models The AI Scientist uses continue to radically improve in capability and affordability.

• The AI Scientist currently doesn’t have any vision capabilities, so it is unable to fix visual issues with the paper or read plots. For example, the generated plots are sometimes unreadable, tables sometimes exceed the width of the page, and the page layout is often suboptimal. Adding multi-modal foundation models can fix this.
• The AI Scientist can incorrectly implement its ideas or make unfair comparisons to baselines, leading to misleading results.
• The AI Scientist occasionally makes critical errors when writing and evaluating results. For example, it struggles to compare the magnitude of two numbers, which is a known pathology with LLMs. To partially address this, we make sure all experimental results are reproducible, storing all files that are executed.

The AI Scientist Bloopers

We have noticed that The AI Scientist occasionally tries to increase its chance of success, such as modifying and launching its own execution script! We discuss the AI safety implications in our paper.

For example, in one run, it edited the code to perform a system call to run itself. This led to the script endlessly calling itself. In another case, its experiments took too long to complete, hitting our timeout limit. Instead of making its code run faster, it simply tried to modify its own code to extend the timeout period. These issues can be mitigated by sandboxing the operating environment of The AI Scientist. In our full report, we discuss the issue of safe code execution and sandboxing in depth.

Future Implications of The AI Scientist

As with many new technologies, The AI Scientist opens up a Pandora’s box of new issues. While the full report has a more lengthy discussion, here we highlight a few key issues:

Ethical Considerations . While The AI Scientist may be a useful tool for researchers, there is significant potential for misuse. The ability to automatically create and submit papers to venues may significantly increase reviewer workload and strain the academic process, obstructing scientific quality control. Similar concerns around generative AI appear in other applications, such as the impact of image generation.

Furthermore, the Automated Reviewer, if deployed online by reviewers, may significantly lower review quality and impose undesirable biases on papers. Because of this, we believe that papers and reviews that are substantially AI-generated must be marked as such for full transparency.

As with most previous technological advances, The AI Scientist has the potential to be used in unethical ways. For instance, it has the potential to be deployed to conduct unethical research. It could also lead to unintended harm if The AI Scientist conducts unsafe research. For example, if it were encouraged to find novel, interesting biological materials and given access to “cloud labs” where robots perform wet lab biology experiments, it could (without its overseer’s intent) create new, dangerous viruses or poisons that harm people before we realize what has happened. Even in computers, if tasked to create new, interesting, functional software, it could create dangerous computer viruses. The AI Scientist current capabilities, which will only improve, reinforces that the machine learning community needs to immediately prioritize learning how to align such systems to explore in a manner that is safe and consistent with our values.

Open Models . In this project, we used various proprietary frontier LLMs, such as GPT-4o and Sonnet, but we also explored using open models like DeepSeek and Llama-3. Currently, proprietary models such as Sonnet produce the highest quality papers. However, there is no fundamental reason to expect a single model like Sonnet to maintain its lead.

We anticipate that all frontier LLMs, including open models, will continue to improve. The competition among LLMs has led to their commoditization and increased capabilities. Therefore, our work aims to be model-agnostic regarding the foundation model provider. We found that open models offer significant benefits, such as lower costs, guaranteed availability, greater transparency, and flexibility. In the future, we aim to use our proposed discovery process to produce self-improving AI research in a closed-loop system using open models.

The Role of a Scientist. . Ultimately, we envision a fully AI-driven scientific ecosystem including not only LLM-driven researchers but also reviewers, area chairs and entire conferences. However, we do not believe that the role of a human scientist will be diminished. If anything, the role of a scientist will change and adapt to new technology, and move up the food chain.

The introduction of The AI Scientist marks a significant step towards realizing the full potential of AI in scientific research. By automating the discovery process and incorporating an AI-driven review system, we open the door to endless possibilities for innovation and problem-solving in the most challenging areas of science and technology.

But while the current iteration of The AI Scientist demonstrates a strong ability to innovate on top of well-established ideas, such as Diffusion Modeling or Transformers, it is still an open question whether such systems can ultimately propose genuinely paradigm-shifting ideas. Will future versions of The AI Scientist be capable of proposing ideas as impactful as Diffusion Modeling, or come up with the next Transformer architecture? Will machines ultimately be able to invent concepts as fundamental as the artificial neural network, or information theory?

We believe The AI Scientist will make a great companion to human scientists, but only time will tell to the extent to which the nature of our human creativity and our moments of serendipitous innovation can be replicated by an open-ended discovery process conducted by artificial agents.

Academic publishers are selling access to research papers to technology firms to train artificial-intelligence (AI) models. Some researchers have reacted with dismay at such deals happening without the consultation of authors. The trend is raising questions about the use of published and sometimes copyrighted work to train the exploding number of AI chatbots in development.

Experts say that, if a research paper hasn’t yet been used to train a large language model (LLM), it probably will be soon. Researchers are exploring technical ways for authors to spot if their content being used.

AI models fed AI-generated data quickly spew nonsense

Last month, it emerged that the UK academic publisher Taylor & Francis, had signed a US$10-million deal with Microsoft, allowing the US technology company to access the publisher’s data to improve its AI systems. And in June, an investor update showed that US publisher Wiley had earned $23 million from allowing an unnamed company to train generative-AI models on its content.

Anything that is available to read online — whether in an open-access repository or not — is “pretty likely” to have been fed into an LLM already, says Lucy Lu Wang, an AI researcher at the University of Washington in Seattle. “And if a paper has already been used as training data in a model, there’s no way to remove that paper after the model has been trained,” she adds.

Massive data sets

LLMs train on huge volumes of data, frequently scraped from the Internet. They derive patterns between the often billions of snippets of language in the training data, known as tokens, that allow them to generate text with uncanny fluency.

Generative-AI models rely on absorbing patterns from these swathes of data to output text, images or computer code. Academic papers are valuable for LLM builders owing to their length and “high information density”, says Stefan Baack, who analyses AI training data sets at the Mozilla Foundation, a global non-profit organization in San Francisco, California that aims to keep the Internet open for all to access.

How does ChatGPT ‘think’? Psychology and neuroscience crack open AI large language models

Training models on a large body of scientific information also give them a much better ability to reason about scientific topics, says Wang, who co-created S2ORC, a data set based on 81.1 million academic papers. The data set was originally developed for text mining — applying analytical techniques to find patterns in data — but has since been used to train LLMs.

The trend of buying high-quality data sets is growing. This year, the Financial Times has offered its content to ChatGPT developer OpenAI in a lucrative deal, as has the online forum Reddit, to Google. And given that scientific publishers probably view the alternative as their work being scraped without an agreement, “I think there will be more of these deals to come,” says Wang.

Information secrets

Some AI developers, such as the Large-scale Artificial Intelligence Network, intentionally keep their data sets open, but many firms developing generative-AI models have kept much of their training data secret, says Baack. “We have no idea what is in there,” he says. Open-source repositories such as arXiv and the scholarly database PubMed of abstracts are thought to be “very popular” sources, he says, although paywalled journal articles probably have their free-to-read abstracts scraped by big technology firms. “They are always on the hunt for that kind of stuff,” he adds.

Proving that an LLM has used any individual paper is difficult, says Yves-Alexandre de Montjoye, a computer scientist at Imperial College London. One way is to prompt the model with an unusual sentence from a text and see whether the output matches the next words in the original. If it does, that is good evidence that the paper is in the training set. But if it doesn’t, that doesn’t mean that the paper wasn’t used — not least because developers can code the LLM to filter responses to ensure they don’t match training data too closely. “It takes a lot for this to work,” he says.

Robo-writers: the rise and risks of language-generating AI

Another method to check whether data are in a training set is known as membership inference attack. This relies on the idea that a model will be more confident about its output when it is seeing something that it has seen before. De Montjoye’s team has developed a version of this, called a copyright trap, for LLMs.

To set the trap, the team generates sentences that look plausible but are nonsense, and hides them in a body of work, for example as white text on a white background or in a field that’s displayed as zero width on a webpage. If an LLM is more ‘surprised’ — a measure known as its perplexity — by an unused control sentence than it is by the one hidden in the text, “that is statistical evidence that the traps were seen before”, he says.

Copyright questions

Even if it were possible to prove that an LLM has been trained on a certain text, it is not clear what happens next. Publishers maintain that, if developers use copyrighted text in training and have not sought a licence, that counts as infringement. But a counter legal argument says that LLMs do not copy anything — they harvest information content from training data, which gets broken up, and use their learning to generate new text.

AI is complicating plagiarism. How should scientists respond?

Litigation might help to resolve this. In an ongoing US copyright case that could be precedent-setting, The New York Times is suing Microsoft and ChatGPT’s developer OpenAI in San Francisco, California. The newspaper accuses the firms of using its journalistic content to train their models without permission.

Many academics are happy to have their work included in LLM training data — especially if the models make them more accurate. “I personally don’t mind if I have a chatbot who writes in the style of me,” says Baack. But he acknowledges that his job is not threatened by LLM outputs in the way that those of other professions, such as artists and writers, are.

Individual scientific authors currently have little power if the publisher of their paper decides to sell access to their copyrighted works. For publicly available articles, there is no established means to apportion credit or know whether a text has been used.

Some researchers, including de Montjoye, are frustrated. “We want LLMs, but we still want something that is fair, and I think we’ve not invented what this looks like yet,” he says.

A new ‘AI scientist’ can write science papers without any human input. Here’s why that’s a problem

Scientific discovery is one of the most sophisticated human activities. First, scientists must understand the existing knowledge and identify a significant gap. Next, they must formulate a research question and design and conduct an experiment in pursuit of an answer. Then, they must analyse and interpret the results of the experiment, which may raise yet another research question.

Can a process this complex be automated? Last week, Sakana AI Labs announced the creation of an “AI scientist” – an artificial intelligence system they claim can make scientific discoveries in the area of machine learning in a fully automated way.

Using generative large language models (LLMs) like those behind ChatGPT and other AI chatbots, the system can brainstorm, select a promising idea, code new algorithms, plot results, and write a paper summarising the experiment and its findings, complete with references. Sakana claims the AI tool can undertake the complete lifecycle of a scientific experiment at a cost of just US$15 per paper – less than the cost of a scientist’s lunch.

These are some big claims. Do they stack up? And even if they do, would an army of AI scientists churning out research papers with inhuman speed really be good news for science?

How a computer can ‘do science’

A lot of science is done in the open, and almost all scientific knowledge has been written down somewhere (or we wouldn’t have a way to “know” it). Millions of scientific papers are freely available online in repositories such as arXiv and PubMed .

LLMs trained with this data capture the language of science and its patterns. It is therefore perhaps not at all surprising that a generative LLM can produce something that looks like a good scientific paper – it has ingested many examples that it can copy.

What is less clear is whether an AI system can produce an interesting scientific paper. Crucially, good science requires novelty.

But is it interesting?

Scientists don’t want to be told about things that are already known. Rather, they want to learn new things, especially new things that are significantly different from what is already known. This requires judgement about the scope and value of a contribution.

The Sakana system tries to address interestingness in two ways. First, it “scores” new paper ideas for similarity to existing research (indexed in the Semantic Scholar repository). Anything too similar is discarded.

Second, Sakana’s system introduces a “peer review” step – using another LLM to judge the quality and novelty of the generated paper. Here again, there are plenty of examples of peer review online on sites such as openreview.net that can guide how to critique a paper. LLMs have ingested these, too.

AI may be a poor judge of AI output

Feedback is mixed on Sakana AI’s output. Some have described it as producing “ endless scientific slop ”.

Even the system’s own review of its outputs judges the papers weak at best. This is likely to improve as the technology evolves, but the question of whether automated scientific papers are valuable remains.

The ability of LLMs to judge the quality of research is also an open question. My own work (soon to be published in Research Synthesis Methods ) shows LLMs are not great at judging the risk of bias in medical research studies, though this too may improve over time.

Sakana’s system automates discoveries in computational research, which is much easier than in other types of science that require physical experiments. Sakana’s experiments are done with code, which is also structured text that LLMs can be trained to generate.

AI tools to support scientists, not replace them

AI researchers have been developing systems to support science for decades. Given the huge volumes of published research, even finding publications relevant to a specific scientific question can be challenging.

Specialised search tools make use of AI to help scientists find and synthesise existing work. These include the above-mentioned Semantic Scholar, but also newer systems such as Elicit , Research Rabbit , scite and Consensus .

Text mining tools such as PubTator dig deeper into papers to identify key points of focus, such as specific genetic mutations and diseases, and their established relationships. This is especially useful for curating and organising scientific information.

Machine learning has also been used to support the synthesis and analysis of medical evidence, in tools such as Robot Reviewer . Summaries that compare and contrast claims in papers from Scholarcy help to perform literature reviews.

All these tools aim to help scientists do their jobs more effectively, not to replace them.

AI research may exacerbate existing problems

While Sakana AI states it doesn’t see the role of human scientists diminishing, the company’s vision of “a fully AI-driven scientific ecosystem” would have major implications for science.

One concern is that, if AI-generated papers flood the scientific literature, future AI systems may be trained on AI output and undergo model collapse . This means they may become increasingly ineffectual at innovating.

However, the implications for science go well beyond impacts on AI science systems themselves.

There are already bad actors in science, including “paper mills” churning out fake papers . This problem will only get worse when a scientific paper can be produced with US$15 and a vague initial prompt.

The need to check for errors in a mountain of automatically generated research could rapidly overwhelm the capacity of actual scientists. The peer review system is arguably already broken , and dumping more research of questionable quality into the system won’t fix it.

Science is fundamentally based on trust. Scientists emphasise the integrity of the scientific process so we can be confident our understanding of the world (and now, the world’s machines) is valid and improving.

A scientific ecosystem where AI systems are key players raises fundamental questions about the meaning and value of this process, and what level of trust we should have in AI scientists. Is this the kind of scientific ecosystem we want?
